Abstract
Accurate estimation of interface orientation is crucial for ensuring both the accuracy and robustness of Volume of Fluid (VOF) schemes in multiphase flow simulations, especially when using non-uniform Cartesian meshes. Conventional gradient reconstruction approaches, such as least-squares (LSQ) methods, often suffer from significant errors and strong oscillations on highly stretched grids. This work proposes a grid-transferable, learning-based methodology that predicts interface unit normal vectors directly from the local volume-fraction field on nonuniform structured Cartesian grids using a feedforward neural network. The methodology extends earlier work originally developed for uniform grids, which is first reproduced to assess how performance deteriorates in the presence of grid non-uniformity. A new model is then trained on a synthetically generated dataset consisting of radially symmetric, star-shaped interfaces with analytically prescribed normals, sampled on non-uniform grids exhibiting cell aspect ratios up to 1000. Furthermore, specialized models trained on limited aspect-ratio intervals are used to systematically investigate sensitivity to grid stretching. In addition to global accuracy measures, a detailed error analysis is performed to characterize error trends, spatial patterns, and statistical properties over a broad spectrum of grid configurations. Performance evaluation using the mean angular error indicates improvements of more than 78.3% compared with standard LSQ reconstructions, along with a pronounced decrease in oscillatory behavior. Examination of the error distribution shows a significant contraction of the error tail and enhanced robustness on strongly anisotropic meshes. Correlation analyses additionally characterize how prediction error relates to local grid descriptors, such as cell aspect ratio, stretching gradients, and stencil anisotropy, thereby clarifying the mechanisms that control model performance. Grid-convergence studies verify second-order accuracy of the learned predictor, in contrast to the poor and inconsistent convergence observed in LSQ-based approaches. The proposed approach generalizes well to unseen grid configurations, including varying stretching rates, resolutions, and irregular quadratic grids, while preserving high accuracy on uniform meshes excluded from training. Detailed error diagnostics underscore the importance of embedding local geometric grid information in the input representation and demonstrate a robust, scalable, easily integrable basis for improving interface-normal prediction in VOF solvers on challenging non-uniform Cartesian grids.

تطوير نهج جديد لديناميكا الموائع الحسابية للتنبؤ بالتدفق متعدد الأطوار المعزز بالتعلم الآلي
يُعدّ التقدير الدقيق لاتجاه الواجهة عاملاً حاسماً لضمان دقة وصلابة طرق حل حجم السائل في محاكاة الجريان متعدد الأطوار، ولا سيما عند استخدام شبكات كارتزية غير منتظمة. إذ إنّ أساليب إعادة بناء المتجهات الاتجاهية التقليدية، مثل طرائق المربعات الصغرى، تعاني غالباً من أخطاء كبيرة وسلوك تذبذبي قوي على الشبكات عالية الاستطالة. تقدم هذه الأطروحة منهجية جديدة قائمة على التعلّم وقابلة للنقل بين الشبكات، تقوم بالتنبؤ مباشرةً بالمتجهات العمودية المعيارية على الواجهة انطلاقاً من حقل الكسر المجمي المحلي على شبكات كارتزية غير منتظمة، وذلك باستخدام شبكة عصبية أمامية مدمجة. تمتد المنهجية المقترحة لعمل سابق طُوِّر أساساً للشبكات المنتظمة، حيث يُعاد أولاً إنتاج هذا العمل لتقييم مدى تدهور الأداء في وجود لا انتظام شبكي. بعد ذلك، يُجرى تدريب نموذج جديد على مجموعة بيانات تركيبية مُولَّدة عددياً تتألف من واجهات نجمية الشكل ذات تناظر شعاعي، ذات متجهات عمودية معرَّفة تحليلياً، ومأخوذة عيناتها على شبكات غير منتظمة تُظهر نِسَب أبعاد للخلايا تصل إلى 1000. علاوة على ذلك، تُستخدَم نماذج متخصصة مُدرَّبة على مجالات محددة من نِسب الأبعاد لدراسة حساسية الأداء بشكل منهجي تجاه درجة استطالة الشبكة. وإضافةً إلى مقاييس الدقة الشاملة، تُجرى تحليلات خطأ تفصيلية لوصف اتجاهات الخطأ، وأنماطه المكانية، وخصائصه الإحصائية عبر طيف واسع من التهيئات الشبكية. تُظهر دراسة الأداء، باستخدام متوسّط الخطأ الزاوي، تحسينات تتجاوز 78.3% مقارنةً بإعادات البناء القياسية القائمة على المربعات الصغرى، إلى جانب انخفاض ملحوظ في السلوك التذبذبي. كما يُبيّن فحص توزّع الخطأ حدوث انكماش واضح في ذيل التوزيع وتحسّناً في المتانة على الشبكات شديدة اللاتناسب. وتقدّم تحليلات الارتباط توصيفاً إضافياً لكيفية ارتباط خطأ التنبؤ بالمواصّفات الشبكية المحلية، مثل نسبة أبعاد الخلية، وتدرّجات الاستطالة، ولا تناظر القالب العددي، الأمر الذي يوضّح الآليات المتحكّمة في أداء النموذج. وتؤكّد دراسات تقارب الشبكة تحقق دقة من المرتبة الثانية للمنبئ المتعلِّم، في تباين واضح مع التقارب الضعيف وغير المتسق الذي تُظهره الأساليب المعتمدة على المربعات الصغرى. تُبيّن النتائج أن النهج المقترح يمتلك قدرة تعميم جيدة على تهيئات شبكية غير مُشاهَدة أثناء التدريب، بما في ذلك معدلات استطالة مختلفة، ودقّات مكانية متباينة، وشبكات تربيعية غير منتظمة، مع الحفاظ في الوقت ذاته على دقة عالية على الشبكات المنتظمة التي لم تُدرَج في بيانات التدريب. وتُبرز تحليلات الخطأ التفصيلية أهمية تضمين المعلومات الهندسية المحلية للشبكة في تمثيل المدخلات، كما تُظهر أن المنهجية المقترحة توفّر أساساً متيناً وقابلاً للتوسع وسهل الدمج لتحسين التنبؤ بالمتجهات العمودية على الواجهة في محلِّلات حجم السائل العاملة على الشبكات الكارتزية غير المنتظمة الصعبة.
